English

Assessing the physical health of wheat grains is crucial for effective supply chain management and food security. In regions such as western Iran, this process traditionally relies on manual visual inspection—a method that is slow, prone to human error, and often leads to inaccurate pricing. To address these shortcomings, this study introduces a fully automated, deep learning-based approach. Our core innovation lies in integrating an enhanced U-Net architecture with a powerful, pre-trained ResNet-50 backbone and employing a class-weighting technique to overcome key challenges such as grain adhesion and class imbalance (i.e., the scarcity of defective kernels). The developed model performs pixel-wise semantic segmentation, classifying images into four distinct categories: background, healthy, unhealthy (broken), and shriveled kernels. Evaluated on an independent test set of 227 images using 5-fold cross-validation, the model achieved a high overall pixel accuracy of 98.2% and a mean Intersection over Union (IoU) score of 0.62. A significant practical advantage is its high inference speed of 0.08 seconds per image, enabling real-time processing. The results demonstrate that this solution provides an accurate, rapid, and reliable tool capable of effectively replacing error-prone manual inspection. It eliminates human subjectivity and provides a standardized, automatable method for assessing grain quality in procurement centers, border inspection stations, and smart farming systems.
